Online Sufficient Dimension Reduction Through Sliced Inverse Regression

Sliced inverse regression is an effective paradigm that achieves the goal of dimension reduction through replacing high dimensional covariates with a small number of linear combinations. It does not impose parametric assumptions on the dependence structure. More importantly, such a reduction of dimension is sufficient in that it does not cause loss of information. In this paper, we adapt the stationary sliced inverse regression to cope with the rapidly changing environments. We propose to implement sliced inverse regression in an online fashion. This online learner consists of two steps. In the first step we construct an online estimate for the kernel matrix; in the second step we propose two online algorithms, one is motivated by the perturbation method and the other is originated from the gradient descent optimization, to perform online singular value decomposition. The theoretical properties of this online learner are established. We demonstrate the numerical performance of this online learner through simulations and real world applications. All numerical studies confirm that this online learner performs as well as the batch learner.

Abstract:
The use of Markov random field (MRF) models has proven to be a fruitful approach in a wide range of image processing applications. It allows local texture information to be incorporated in a systematic and unified way and allows statistical inference theory to be applied giving rise to novel output summaries and enhanced image interpretation. A great advantage of such low-level approaches is that they lead to flexible models, which can be applied to a wide range of imaging problems without the need for significant modification. This paper proposes and explores the use of conditional MRF models for situations where multiple images are to be processed simultaneously, or where only a single image is to be reconstructed and a sequential approach is taken. Although the coupling of image intensity values is a special case of our approach, the main extension over previous proposals is to allow the direct coupling of other properties, such as smoothness or texture. This is achieved using a local modulating function which adjusts the influence of global smoothing without the need for a fully inhomogeneous prior model. Several modulating functions are considered and a detailed simulation study, motivated by remote sensing applications in archaeological geophysics, of conditional reconstruction is presented. The results demonstrate that a substantial improvement in the quality of the image reconstruction, in terms of errors and residuals, can be achieved using this approach, especially at locations with rapid changes in the underlying intensity.

A priori generalization error for two-layer ReLU neural network through minimum norm solution. (arXiv:1912.03011v3 [cs.LG] UPDATED)

We focus on estimating emph{a priori} generalization error of two-layer ReLU neural networks (NNs) trained by mean squared error, which only depends on initial parameters and the target function, through the following research line. We first estimate emph{a priori} generalization error of finite-width two-layer ReLU NN with constraint of minimal norm solution, which is proved by cite{zhang2019type} to be an equivalent solution of a linearized (w.r.t. parameter) finite-width two-layer NN. As the width goes to infinity, the linearized NN converges to the NN in Neural Tangent Kernel (NTK) regime citep{jacot2018neural}. Thus, we can derive the emph{a priori} generalization error of two-layer ReLU NN in NTK regime. The distance between NN in a NTK regime and a finite-width NN with gradient training is estimated by cite{arora2019exact}. Based on the results in cite{arora2019exact}, our work proves an emph{a priori} generalization error bound of two-layer ReLU NNs. This estimate uses the intrinsic implicit bias of the minimum norm solution without requiring extra regularity in the loss function. This emph{a priori} estimate also implies that NN does not suffer from curse of dimensionality, and a small generalization error can be achieved without requiring exponentially large number of neurons. In addition the research line proposed in this paper can also be used to study other properties of the finite-width network, such as the posterior generalization error.

FNNC: Achieving Fairness through Neural Networks. (arXiv:1811.00247v3 [cs.LG] UPDATED)

In classification models fairness can be ensured by solving a constrained optimization problem. We focus on fairness constraints like Disparate Impact, Demographic Parity, and Equalized Odds, which are non-decomposable and non-convex. Researchers define convex surrogates of the constraints and then apply convex optimization frameworks to obtain fair classifiers. Surrogates serve only as an upper bound to the actual constraints, and convexifying fairness constraints might be challenging.

We propose a neural network-based framework, emph{FNNC}, to achieve fairness while maintaining high accuracy in classification. The above fairness constraints are included in the loss using Lagrangian multipliers. We prove bounds on generalization errors for the constrained losses which asymptotically go to zero. The network is optimized using two-step mini-batch stochastic gradient descent. Our experiments show that FNNC performs as good as the state of the art, if not better. The experimental evidence supplements our theoretical guarantees. In summary, we have an automated solution to achieve fairness in classification, which is easily extendable to many fairness constraints.

Interpreting Deep Models through the Lens of Data. (arXiv:2005.03442v1 [cs.LG])

Identification of input data points relevant for the classifier (i.e. serve as the support vector) has recently spurred the interest of researchers for both interpretability as well as dataset debugging. This paper presents an in-depth analysis of the methods which attempt to identify the influence of these data points on the resulting classifier. To quantify the quality of the influence, we curated a set of experiments where we debugged and pruned the dataset based on the influence information obtained from different methods. To do so, we provided the classifier with mislabeled examples that hampered the overall performance. Since the classifier is a combination of both the data and the model, therefore, it is essential to also analyze these influences for the interpretability of deep learning models. Analysis of the results shows that some interpretability methods can detect mislabels better than using a random approach, however, contrary to the claim of these methods, the sample selection based on the training loss showed a superior performance.

Efficient Characterization of Dynamic Response Variation Using Multi-Fidelity Data Fusion through Composite Neural Network. (arXiv:2005.03213v1 [stat.ML])

Uncertainties in a structure is inevitable, which generally lead to variation in dynamic response predictions. For a complex structure, brute force Monte Carlo simulation for response variation analysis is infeasible since one single run may already be computationally costly. Data driven meta-modeling approaches have thus been explored to facilitate efficient emulation and statistical inference. The performance of a meta-model hinges upon both the quality and quantity of training dataset. In actual practice, however, high-fidelity data acquired from high-dimensional finite element simulation or experiment are generally scarce, which poses significant challenge to meta-model establishment. In this research, we take advantage of the multi-level response prediction opportunity in structural dynamic analysis, i.e., acquiring rapidly a large amount of low-fidelity data from reduced-order modeling, and acquiring accurately a small amount of high-fidelity data from full-scale finite element analysis. Specifically, we formulate a composite neural network fusion approach that can fully utilize the multi-level, heterogeneous datasets obtained. It implicitly identifies the correlation of the low- and high-fidelity datasets, which yields improved accuracy when compared with the state-of-the-art. Comprehensive investigations using frequency response variation characterization as case example are carried out to demonstrate the performance.

Abstract:
We consider estimation and inference in a single index regression model with an unknown but smooth link function. In contrast to the standard approach of using kernels or regression splines, we use smoothing splines to estimate the smooth link function. We develop a method to compute the penalized least squares estimators (PLSEs) of the parametric and the nonparametric components given independent and identically distributed (i.i.d.) data. We prove the consistency and find the rates of convergence of the estimators. We establish asymptotic normality under mild assumption and prove asymptotic efficiency of the parametric component under homoscedastic errors. A finite sample simulation corroborates our asymptotic theory. We also analyze a car mileage data set and a Ozone concentration data set. The identifiability and existence of the PLSEs are also investigated.

Resolving the Spatial Profile of Figure Enhancement in Human V1 through Population Receptive Field Modeling

The detection and segmentation of meaningful figures from their background is one of the primary functions of vision. While work in nonhuman primates has implicated early visual mechanisms in this figure–ground modulation, neuroimaging in humans has instead largely ascribed the processing of figures and objects to higher stages of the visual hierarchy. Here, we used high-field fMRI at 7 Tesla to measure BOLD responses to task-irrelevant orientation-defined figures in human early visual cortex (N = 6, four females). We used a novel population receptive field mapping-based approach to resolve the spatial profiles of two constituent mechanisms of figure–ground modulation: a local boundary response, and a further enhancement spanning the full extent of the figure region that is driven by global differences in features. Reconstructing the distinct spatial profiles of these effects reveals that figure enhancement modulates responses in human early visual cortex in a manner consistent with a mechanism of automatic, contextually driven feedback from higher visual areas.

SIGNIFICANCE STATEMENT A core function of the visual system is to parse complex 2D input into meaningful figures. We do so constantly and seamlessly, both by processing information about visible edges and by analyzing large-scale differences between figure and background. While influential neurophysiology work has characterized an intriguing mechanism that enhances V1 responses to perceptual figures, we have a poor understanding of how the early visual system contributes to figure–ground processing in humans. Here, we use advanced computational analysis methods and high-field human fMRI data to resolve the distinct spatial profiles of local edge and global figure enhancement in the early visual system (V1 and LGN); the latter is distinct and consistent with a mechanism of automatic, stimulus-driven feedback from higher-level visual areas.

Nitric Oxide Signaling Strengthens Inhibitory Synapses of Cerebellar Molecular Layer Interneurons through a GABARAP-Dependent Mechanism

Nitric oxide (NO) is an important signaling molecule that fulfills diverse functional roles as a neurotransmitter or diffusible second messenger in the developing and adult CNS. Although the impact of NO on different behaviors such as movement, sleep, learning, and memory has been well documented, the identity of its molecular and cellular targets is still an area of ongoing investigation. Here, we identify a novel role for NO in strengthening inhibitory GABAA receptor-mediated transmission in molecular layer interneurons of the mouse cerebellum. NO levels are elevated by the activity of neuronal NO synthase (nNOS) following Ca2+ entry through extrasynaptic NMDA-type ionotropic glutamate receptors (NMDARs). NO activates protein kinase G with the subsequent production of cGMP, which prompts the stimulation of NADPH oxidase and protein kinase C (PKC). The activation of PKC promotes the selective strengthening of α3-containing GABAARs synapses through a GABA receptor-associated protein-dependent mechanism. Given the widespread but cell type-specific expression of the NMDAR/nNOS complex in the mammalian brain, our data suggest that NMDARs may uniquely strengthen inhibitory GABAergic transmission in these cells through a novel NO-mediated pathway.

SIGNIFICANCE STATEMENT Long-term changes in the efficacy of GABAergic transmission is mediated by multiple presynaptic and postsynaptic mechanisms. A prominent pathway involves crosstalk between excitatory and inhibitory synapses whereby Ca2+-entering through postsynaptic NMDARs promotes the recruitment and strengthening of GABAA receptor synapses via Ca2+/calmodulin-dependent protein kinase II. Although Ca2+ transport by NMDARs is also tightly coupled to nNOS activity and NO production, it has yet to be determined whether this pathway affects inhibitory synapses. Here, we show that activation of NMDARs trigger a NO-dependent pathway that strengthens inhibitory GABAergic synapses of cerebellar molecular layer interneurons. Given the widespread expression of NMDARs and nNOS in the mammalian brain, we speculate that NO control of GABAergic synapse efficacy may be more widespread than has been appreciated.

Neonatal Stroke and TLR1/2 Ligand Recruit Myeloid Cells through the Choroid Plexus in a CX3CR1-CCR2- and Context-Specific Manner

Neonatal stroke is as frequent as stroke in the elderly, but many pathophysiological injury aspects are distinct in neonates, including immune signaling. While myeloid cells can traffic into the brain via multiple routes, the choroid plexus (CP) has been identified as a uniquely educated gate for immune cell traffic during health and disease. To understand the mechanisms of myeloid cell trafficking via the CP and their influence on neonatal stroke, we characterized the phenotypes of CP-infiltrating myeloid cells after transient middle cerebral artery occlusion (tMCAO) in neonatal mice of both sexes in relation to blood-brain barrier permeability, injury, microglial activation, and CX3CR1-CCR2 signaling, focusing on the dynamics early after reperfusion. We demonstrate rapid recruitment of multiple myeloid phenotypes in the CP ipsilateral to the injury, including inflammatory CD45+CD11b+Ly6chighCD86+, beneficial CD45+CD11b+Ly6clowCD206+, and CD45+CD11b+Ly6clowLy6ghigh cells, but only minor leukocyte infiltration into acutely ischemic-reperfused cortex and negligible vascular albumin leakage. We report that CX3CR1-CCR2-mediated myeloid cell recruitment contributes to stroke injury. Considering the complexity of inflammatory cascades triggered by stroke and a role for TLR2 in injury, we also used direct TLR2 stimulation as an independent injury model. TLR2 agonist rapidly recruited myeloid cells to the CP, increased leukocytosis in the CSF and blood, but infiltration into the cortex remained low over time. While the magnitude and the phenotypes of myeloid cells diverged between tMCAO and TLR2 stimulation, in both models, disruption of CX3CR1-CCR2 signaling attenuated both monocyte and neutrophil trafficking to the CP and cortex.

SIGNIFICANCE STATEMENT Stroke during the neonatal period leads to long-term disabilities. The mechanisms of ischemic injury and inflammatory response differ greatly between the immature and adult brain. We examined leukocyte trafficking via the choroid plexus (CP) following neonatal stroke in relation to blood-brain barrier integrity, injury, microglial activation, and signaling via CX3CR1 and CCR2 receptors, or following direct TLR2 stimulation. Ischemia-reperfusion triggered marked unilateral CX3CR1-CCR2 dependent accumulation of diverse leukocyte subpopulations in the CP without inducing extravascular albumin leakage or major leukocyte infiltration into the brain. Disrupted CX3CR1-CCR2 signaling was neuroprotective in part by attenuating monocyte and neutrophil trafficking. Understanding the migratory patterns of CP-infiltrating myeloid cells with intact and disrupted CX3CR1-CCR2 signaling could identify novel therapeutic targets to protect the neonatal brain.

Pope Francis: the devil seeks to destroy the Church through envy

Vatican City, May 9, 2020 / 04:00 am (CNA).- The devil uses envy to try to thwart the proclamation of the Gospel, Pope Francis said at his morning Mass Saturday.

In his homily in the chapel at Casa Santa Marta, May 9, the pope reflected on the day’s first reading, Acts 13:44-52, in which the Jewish community at Antioch rejects St. Paul’s preaching about Jesus. 

He said: “On the one hand there is the Lord, there is the Holy Spirit who makes the Church grow, and it grows ever more: this is true. But on the other hand, there is the evil spirit that seeks to destroy the Church.” 

After citing other examples in the Acts of the Apostles where the apostles faced rejection, the pope asked: “And what is the devil's instrument to destroy the Gospel proclamation? Envy. The Book of Wisdom [2:24] says it clearly: ‘Through the devil's envy sin has entered the world’ -- envy, jealousy, here. Always this bitter, bitter feeling.” 

Reflecting on this enduring struggle, Pope Francis quoted St. Augustine of Hippo, who wrote in “The City of God” that “the Church progresses on her pilgrimage amidst this world's persecutions and God's consolations.”

“A Church that has no difficulty lacks something,” he said. “The devil is too calm. And if the devil is calm, things are not going well. Always the difficulty, the temptation, the struggle... the jealousy that destroys. The Holy Spirit creates the harmony of the Church, and the evil spirit destroys. Until today.” 

The pope noted that in the first reading the community at Antioch turned the leading women and men of the city against the apostles. He observed that temporal powers are often an instrument through which envy is stirred up against Christians. 

He said: “Let us be careful with the preaching of the Gospel: never to fall, to put our trust in temporal powers and money. The trust of Christians is Jesus Christ and the Holy Spirit that He sent, and it is precisely the Holy Spirit who is the leaven, it is the strength that makes the Church grow.” 

“Yes, the Church goes ahead, in peace, with resignation, joyful: between ‘the consolations of God and the persecutions of the world.’”

The pope led those watching via livestream in an act of spiritual communion, composed by St. Alphonsus Liguori, founder of the Redemptorists.

He prayed: “My Jesus, I believe that you are present in the most Blessed Sacrament. I love You above all things and I desire to receive You into my soul. Since I cannot now receive You sacramentally, come at least spiritually into my heart. I embrace You as if You were already there, and unite myself wholly to You. Never permit me to be separated from You.”

The pope ended the celebration with adoration and benediction of the Blessed Sacrament. The congregation then sang the Easter Marian antiphon “Regina caeli.”

At the start of Mass, the pope noted that May 9 is the feast day of St. Louise de Marillac, the French founder of the Daughters of Charity. Her feast normally falls on March 15 but was transferred this year because it fell on a Sunday in Lent. A painting of the 17th-century saint was brought to the pope’s chapel to mark the occasion. 

The Daughters of Charity belong to the Vincentian family. Vincentian nuns live at the Casa Santa Marta, the pope’s residence, and run a pediatric dispensary at the Vatican.

At the start of Mass, the pope said: “Today is the commemoration of St. Louise de Marillac: let us pray for the Vincentian sisters who have run this clinic, this hospital, for almost 100 years and have worked here, in Santa Marta, for this hospital. May the Lord bless the sisters.”

Always the difficulty, the temptation, the struggle... the jealousy that destroys. The Holy Spirit creates the harmony of the Church, and the evil spirit destroys. Until today.” 

The pope noted that in the first reading the community at Antioch turned the leading women and men of the city against the apostles. He observed that temporal powers are often an instrument through which envy is stirred up against Christians. 

He said: “Let us be careful with the preaching of the Gospel: never to fall, to put our trust in temporal powers and money. The trust of Christians is Jesus Christ and the Holy Spirit that He sent, and it is precisely the Holy Spirit who is the leaven, it is the strength that makes the Church grow.” 

“Yes, the Church goes ahead, in peace, with resignation, joyful: between ‘the consolations of God and the persecutions of the world.’”

The pope led those watching via livestream in an act of spiritual communion, composed by St. Alphonsus Liguori, founder of the Redemptorists.

He prayed: “My Jesus, I believe that you are present in the most Blessed Sacrament. I love You above all things and I desire to receive You into my soul. Since I cannot now receive You sacramentally, come at least spiritually into my heart. I embrace You as if You were already there, and unite myself wholly to You. Never permit me to be separated from You.”

The pope ended the celebration with adoration and benediction of the Blessed Sacrament. The congregation then sang the Easter Marian antiphon “Regina caeli.”

At the start of Mass, the pope noted that May 9 is the feast day of St. Louise de Marillac, the French founder of the Daughters of Charity. Her feast normally falls on March 15 but was transferred this year because it fell on a Sunday in Lent. A painting of the 17th-century saint was brought to the pope’s chapel to mark the occasion. 

The Daughters of Charity belong to the Vincentian family. Vincentian nuns live at the Casa Santa Marta, the pope’s residence, and run a pediatric dispensary at the Vatican.

At the start of Mass, the pope said: “Today is the commemoration of St. Louise de Marillac: let us pray for the Vincentian sisters who have run this clinic, this hospital, for almost 100 years and have worked here, in Santa Marta, for this hospital. May the Lord bless the sisters.”
